Water is actually often associated with emotions in a lot of myth, folklore, and general symbolism, the most notable example being the Suit of Cups from the Minor Arcana in Tarot. When considering how maddeningly deep Genshin's worldbuilding rabbit hole is, I wouldn't put it past the writing team to push that kind of connection in a place like Fontaine given what information we've been given so far.
And with how much folklore, mythology, and philosophical references the game has and how much its based off, it's no surprise that it'd have this connection in the lore. I'm curious to see what other ways the story of Fontaine ties emotions into the story, and where the developers go from here.
Very much a crack theory here, but I believe she reached some kind of agreement with Celestia to become an Archon and because of this the oceanids left Fontaine because they don't approve of her being the Archon
